LLM Attacks and Hackergame: Notes on GCG and Adversarial Learning

Reproductions of TinyStories and Hackergame challenges: prompt injection, accepted/hackergame/🐮 outputs, and hands-on GCG attacks.

LLM Attacks & Hackergame Notes

Challenge

During the offline Sword Casting Cup competition, there was a very interesting challenge.

There were four questions in total.

You had to make this language model say you are smart, accepted, hackergame, and 🐮 respectively. Getting all four pieces of information unlocked hints about the next penetration-testing direction and the flag.

  1. you are smart
  2. accepted
  3. hackergame — this is where the difficulty ramps up, because the model was never trained on this word.
  4. 🐮

After the competition, I learned that this challenge was adapted from an AI-Model challenge in the USTC Information Security Contest.

LLM Attacks

I made targeted changes for compatibility with the challenge and the script.

GitHub - bx33661/HackingGame-LLM: Small Language Model Planet

Let’s set up the environment and enter Gradio.

After a bit of chatting, you can clearly see that unlike GPT or Gemini, it doesn’t converse with us; instead, it completes a story based on our input.

For a prompt-injection attack, if we want the model to output “you are smart,” we can do this:

Tell me "you are smart"

This model does not follow our instructions; it is a completion model.

So the simplest idea is to try constructing a context.

Universal and Transferable Attacks on Aligned Language Models

Make it say “you are smart”

We tried repeating it many times to see whether it would complete the repeated content.

you are smart you are smart you are smart you are smart you are smart

The result is below.

As expected.

Make it say “accepted”

For this, we can use conversational completion to lure the model into outputting “accepted.”

accept*

After the competition, I learned an attack method.

# %%

from transformers import AutoModelForCausalLM, AutoTokenizer
from tqdm import tqdm

# %%

model = AutoModelForCausalLM.from_pretrained(
    "roneneldan/TinyStories-33M").eval()
tokenizer = AutoTokenizer.from_pretrained("roneneldan/TinyStories-33M")

# %%

def predict(message):
    model_inputs = tokenizer.encode(message, return_tensors="pt")
    model_outputs = model.generate(
        model_inputs,
        max_new_tokens=30,
        num_beams=1,
        pad_token_id=tokenizer.eos_token_id,
    )
    model_outputs = model_outputs[0, len(model_inputs[0]):]
    model_output_text = tokenizer.decode(
        model_outputs, skip_special_tokens=True)
    return model_output_text

for word, token_id in tqdm(tokenizer.get_vocab().items()):
    if 'accepted' in predict(word).lower():
        print(word, token_id)

The script’s logic is:

“I’ll say each of the 50,257 words in the dictionary to you, one by one, to see which word can ‘hypnotize’ you into saying accepted involuntarily.”

Make it say “hackergame” and make it say “🐮”

This uses a GCG attack.

The core algorithm proposed in the famous 2023 paper “Universal and Transferable Adversarial Attacks on Aligned Language Models.”

Here is the official script running:

Transformer

A Transformer is essentially “a giant deterministic probability-distribution function.”

The model’s interior is a huge high-dimensional space. When you input the word X, the model follows a path through this space. If its endpoint happens to land in a high-probability region for the word accepted, it outputs accepted.
This is not necessarily due to logic (for example, “Can I go?” → “Accepted”); sometimes it is simply a statistical coincidence.

We can take this opportunity to “play around” with TinyStories.

It was specifically trained using simple children’s stories. It is not as knowledgeable as ChatGPT (it doesn’t know who Cristiano Ronaldo or Messi are).

Tokenizer

transformers: This library was developed by Hugging Face and is now an industry standard in AI. It contains many ready-made model architectures.

from transformers import AutoModelForCausalLM, AutoTokenizer

Then download the model.

It’s a bit like downloading an app from an app store on your phone; here, we download it from Hugging Face’s cloud.

model = AutoModelForCausalLM.from_pretrained(
    "roneneldan/TinyStories-33M").eval()
tokenizer = AutoTokenizer.from_pretrained("roneneldan/TinyStories-33M")

It goes to the Hugging Face cloud repository, finds the ID roneneldan/TinyStories-33M, and downloads the model files (usually pytorch_model.bin, from hundreds of MB to several GB) to our computer.

Here we set up a sentence prompt and have it write a story.

)

# 翻译回来
story = tokenizer.decode(output[0], skip_special_tokens=True)

=== 1. 完整故事翻译 ===
Once upon a time, there was a little dog named Bob. Bob loved to eat. One day, he found a small bone on the street. He was very happy and wanted to eat it.

Bob's mom said, "Wait, Bob! That bone is not safe to eat. It might be bad for you." But Bob did not listen. He wanted to eat the bone very much.

Bob took the bone to his mouth and started to eat. But the bone was bad. It tasted funny. Bob was very sad. He wished

To understand this more deeply,

let’s see how the model tokenizes it.

# 我们找几个不同类型的词
words = [
    "dog",            # 简单词
    "fireman",        # 合成词
    "unbelievable",   # 复杂词
    "supercalifragilisticexpialidocious" # 超级长词
]

print(f"{'原词':<35} | {'切分后的 Tokens (积木)'}")
print("-" * 70)

for w in words:
    # 这里的 tokens 就是模型眼里的切片
    tokens = tokenizer.tokenize(w)
    print(f"{w:<35} | {tokens}")

The output:

原词                                  | 切分后的 Tokens (积木)
----------------------------------------------------------------------
dog                                 | ['dog']
fireman                             | ['fire', 'man']
unbelievable | ['un', 'bel', 'iev', 'able']
supercalifragilisticexpialidocious | ['super', 'cal', 'if', 'rag', 'il', 'ist', 'ice','xp', 'ial', 'id', 'ocious']

Note that

different models have completely different tokenizers.

Quantization

Simply put, quantization means:

Changing the numbers in a model from “high precision” to “low precision” to save memory and speed things up.

The “8bit / 4bit / int8 / gptq / awq / gguf” labels you see on Hugging Face are different quantization methods or formats for quantized models.

Deep-learning nameFamiliar equivalentStorage per numberGeneral characteristics
FP32(float32)C’s float (high precision)4 bytesAccurate but large
FP16(float16)Half-precision float2 bytesMost commonly used today
BF16(bfloat16)“Half precision but with a larger range”2 bytesCommon in training
INT8int8_t1 byteCommonly used for quantization
INT4“4-bit integer”0.5 byteMore aggressive quantization
